Abstract and Figures

We present a new method for automatic detection of peaks in noisy periodic and quasi-periodic signals. The new method, called automatic multiscale-based peak detection (AMPD), is based on the calculation and analysis of the local maxima scalogram, a matrix comprising the scale-dependent occurrences of local maxima. The usefulness of the proposed method is shown by applying the AMPD algorithm to simulated and real-world signals.

Abstract: We present a new method for automatic detection of peaks in noisy periodic and
quasi-periodic signals. The new method, called automatic multiscale-based peak detection
(AMPD), is based on the calculation and analysis of the local maxima scalogram, a matrix
comprising the scale-dependent occurrences of local maxima. The usefulness of
the proposed method is shown by applying the AMPD algorithm to simulated and
real-world signals.

1. Introduction
The detection of peaks in signals is an important step in many signal processing applications. Up to
now, many different methods have been developed, including those based on traditional
window-threshold techniques [14], wavelet transform [513], Hilbert transform [14], combining Hilbert
and wavelet transform [15], artificial neural networks [16,17], techniques using templates [18,19],
morphology filtering [2022], nonlinear filtering [2326], Kalman filtering [27], Gabor filtering [28],
Gaussian second derivative filtering [29], linear prediction analysis [30], higher-order statistics [31],
K-Means clustering [32], fuzzy C-Means clustering [33], Empirical Mode Decomposition [34], hidden
Markov models [35], and techniques using entropy [36], momentum [37], histogram/cumulative

distribution function [38], intensity weighted variance [39], stochastic resonance [40], or a smoothed
nonlinear energy operator [41].
The problem with most of the peak detection algorithms available is that the more generally
applicable the algorithm, the more free parameters (i.e., window length or threshold value) have to be
chosen in order to be able to apply the algorithm to the signal. In contrast, algorithms with only a few
parameters are in general restricted for use in specific applications such as the detection of R-peaks in
electroencephalography (ECG) signals [1,7,8,10,12,1417,2024,3034] or peaks in chromatography
data [3,4]. Additionally the existence of noise in the analyzed signal is a challenge for many of the
peak detection algorithm available.
The unsatisfactory situation with regard to existing peak detection methods motivated the
development of a simple and effective new peak detection algorithm for noisy periodic and
quasi-periodic signals based on the insight that the general applicability of an algorithm could be
preserved by (i) using a multiscale technique to detect all local maxima of the signal and (ii) finding
the ―real peaks‖ by automatically analyzing the results of the multiscale technique applied. In
particular, the goal of our work was to develop a peak detection algorithm that has the properties of
(i) not having any free parameters values that have to be chosen by the user prior to the analysis; (ii)
being able to detect peaks in periodic and quasi-periodic signals; and (iii) having a peak detection
efficiency that is fairly robust against high and low frequency noise.
It should be noted that the goal of the present work was to develop a peak detection algorithm
specifically to detect peaks in noisy periodic and quasi-periodic signals. Thus, it was not the intention
to develop a general peak detection method that is also applicable to non-periodic signals, such as
signals normally obtained in the field of analytical chemistry, including mass spectra, optical spectra or
gas chromatograms.

3. Validation
Two types of simulated data sets (type A and B) were created and used for the validation of the
algorithm. The first type (A) of data set was constructed to evaluate the ability of the AMPD algorithm
to detect peaks in noisy periodic signals. Therefore 5 signals (sampling frequency: 100 Hz, length:
20 s, frequency of the sinus oscillation: 1 Hz) with different amount of Gaussian white noise were
used. The signal-to-noise ratios (SNR) of the final signals were 25 dB, 10 dB, 5 dB and 0 dB.
Additionally one signal without noise was created. The SNR values were calculated according to the

the noise. The second type (B) of data set was constructed to evaluate the ability of the AMPD
algorithm to detect peaks in noisy quasi-periodic signals. Therefore, five chirp signals were created,
each comprising a sinus oscillation with an increasing frequency (start frequency: 1 Hz, end frequency:
3.8 Hz). As for the type A signals, different amounts of noise were added to the signals leading to the
same SNR-values as for the type A signals.
The AMPD algorithm was implemented in Matlab (The Mathworks, Natick, MA, USA). The
results of applying the algorithm to the simulated data sets are visualised in Figures 3 and 4. All peaks
were correctly detected (based on visual inspection) for all types of signal characteristics used.

4. Application Examples
In this section, we present a demonstration of the proposed algorithm on five different time series
originating from different research areas (i.e., astrophysics, biomedical optics, physiology, geophysics
and chaos theory) in the field of natural sciences.
4.1. Sunspot Numbers
The time series analyzed comprises the total monthly number of sunspots, i.e., the number of dark
spots on the solar surface caused by interactions between the solar magnetic field and the Sun’s
plasma [42]. The time series comprises 3151 values and spans a period from January 1749 to July
2011. The data was downloaded from the website of the Solar Influences Data Analysis Center (SIDC)
of the Royal Observatory of Belgium (SIDC-team) [43]. The results of the analysis are given in
Figure 5. All 23 peaks were correctly detected (no false negative errors) and no false detection
occurred (no false positive errors).

4.2. Blood Volume Pulse in fNIRS Signals
Signals measured using functional near-infrared spectroscopy (fNIRS) contain a strong oscillation
that is caused by the blood volume pulse (BVP) related to the arterial blood pressure changes
(systole, diastole). fNIRS is a technique allowing non-invasive measurement of changes in the blood
concentrations of oxyhemoglobin ([O2Hb]) and deoxyhemoglobin ([HHb]) by irradiating light in the
near-infrared spectrum (600950 nm) into the brain and analyzing the reflected light intensity
changes [4446]. The information of the BVP in fNIRS signals is relevant for various reasons, i.e., for
a proper removal of the BVP from fNIRS signals to improve the detection of fast neuronal optical
signals [47,48], or for the usage of a surrogate to the heart rate variability measured with
electrocardiography [49].
In order to demonstrate the applicability of the AMPD algorithm to detect the BVP-peaks in a
fNIRS time series, we used a self-recorded [O2Hb] signal measured on the prefrontal cortex
(sampling frequency: 10 Hz, source-detector distance: 2.5 mm, device: MCP-II, multichannel
continuous-wave NIR-spectroscope, for technical details see [50]). The time series analyzed had a
duration of 200 s (~3.3 min). The results of the analysis are given in Figure 6. All 225 peaks were
correctly detected (no false negative errors) and no false detection occurred (no false positive errors).

4.3. Maximum Concentration of Expired CO2
The CO2 concentration of the exhaled air, measured with capnography, is an important parameter in
medicine and basic physiological research. The waveform of CO2 concentration changes during the
respiratory cycle comprises four phases (I: inspiratory baseline, II: expiratory upstroke, III: expiratory
plateau, and IV: inspiratory downstroke) where the phase IV marks the peak of the whole waveform.
This peak value is called end-tidal CO2 (PETCO2) and is a best approximation of the alveolar CO2
level, i.e., the partial pressure of CO2 in the arterial blood (PaCO2) [51]. A precise and robust
measurement of the phase IV peak is indispensable to correctly determine the PETCO2 values.
The time series analyzed comprised a 500 s long CO2 time series measured on a resting subject
(sampling frequency: 5 Hz, device: Nellcor N1000 gas analyzer, Nellcor. Inc, Hayward, USA). The
results of the analysis are given in Figure 7. All 133 peaks were correctly detected (no false negative
errors) and no false detection occurred (no false positive errors).

4.4. QRS Peaks in ECG Signals
Electrocardiography (ECG) time series contain information about the direction and magnitude of
the electrical activity caused by electrophysiological effects (depolarisation and repolarisation) of the
atria and ventricles. The time series comprises a recurrent sequence of characteristic signal waveforms
(P, QRS, T) where the QRS complex is the most striking element. The maximum of the QRS complex
is the R-peak. The sequence of RR intervals is the heart rate. The variability of the RR interval lengths
is called hart rate variability (HRV), associated with the state of the autonomic nervous system [52].
To demonstrate the usefulness of the proposed AMPD algorithm, we used a self-recorded ECG
signal (sampling frequency: 128 Hz; device: 1-channel ECG, MK3-ETA, TOM-Medical, Graz,
Austria). The analyzed time series had a duration of 200 s (~3.3 min). The results of the analysis are
given in Figure 8. All 221 R-peaks were correctly detected (no false negative errors) and no false
detection occurred (no false positive errors).

4.5. Peaks in the Variation of the Earth’s Length of Day due to Lunar Tidal Forcing
Since the Earth’s rotation rate is not a constant, each day has a different duration (length of day,
LOD) when comparing the astronomically determined duration of a day on Earth with the duration of a
day according to the SI units definition (1 day = 86,400 s) measured using atomic clocks [53]. The
variations in LOD are highly non-stationary and comprise different oscillations. One of the strongest
oscillations present in the LOD time series has the average period of 13.6 days. This oscillation is the
result of a lunar tidal force that the Moon exerts on the Earth’s rotation due to changes in the lunar
declination during the lunar cycle [54].
The proposed AMPD algorithm was tested to establish its ability to detect the peaks of this
lunar-related oscillation in the unfiltered (raw) LOD data. To this end, (i) daily averaged LOD data
were obtained from the International Earth Rotation and Reference Service (IERS) [55]; and (ii) the
peaks of the LOD time series from 2008 to 2011 (1461 days) were detected. The results are given in
Figure 9. In total 105 peaks were detected. One peak was not detected (one false negative error) but no
false detection occurred (no false positive errors). As shown in Figure 9, the missed peak has low
amplitude and is superimposed with a rapidly decreasing part of a slower oscillation (low frequency
noise) which makes the detection difficult. The missed peak detection could be prevented by high-pass
filtering the signal prior to analysis with the AMPD algorithm.

The average duration of the intervals between the peaks was 13.7885 ± 2.1974 days, which
corresponds well with the value reported in literature [54,56].

4.6. Chaos Theory: Lorenz System
The three-dimensional Lorenz system, developed by Edward N. Lorenz in 1963 [57], is a
simplification of the seven-dimensional system developed by Barry Salzman in 1962 [58]. The Lorenz
system is a classic example of a nonlinear system exhibiting chaotic behaviour. It is given by three
ordinary differential equations (Lorenz equations):

with the system parameters σ, ρ and β that determine the dynamic behaviour of the system.
To demonstrate the capability of the proposed AMPD algorithm, (i) the system of ordinary
differential equations given by (5) was solved for the parameter values σ = 10, ρ = 28, β = 8/3, and
[1,3000]t
; and (ii) the peaks of the time series x(t) were detected. The results are given in
Figure 10. All 53 peaks were correctly detected (no false negative errors) and no false detection
occurred (no false positive errors).

5. Discussion and Conclusions
In this paper, we presented a new method, called automatic multiscale-based peak detection
(AMPD), for automatic detection of peaks in noisy periodic and quasi-periodic signals. Compared to
traditional methods for peak detection, the proposed AMPD algorithm has the following advantages:
(i) no free parameter values have to be chosen by the user prior to analysis; (ii) peaks in periodic and
quasi-periodic signals can be detected; and (iii) the peak detection efficiency is fairly robust against
high and low frequency noise. Hence, the presented method results in a high efficiency in detection
of peaks.
Using simulated and real-world signals, the usefulness of the AMPD algorithm was evaluated and
demonstrated. For signals with high amplitude low frequency noise, the performance of the algorithm
can be optimized by high-pass filtering the signal prior to analysis. However, the high-pass filtering is
not necessary for most of the signals as demonstrated.
For future work it would be interesting (i) to further explore the information given in the LMS in
order to find, for example, additional rules for the automatic identification of peaks; (ii) to evaluate the
performance of the AMPD algorithm compared to other peak detection algorithms available; and (iii)
to use and test the algorithm in real world applications.

Results from two independent clinical validation studies for measuring hemodynamics at the patient's bedside using a compact finger probe are reported. Technology comprises a barometric pressure sensor, and in one implementation, additionally, an optical sensor for photoplethysmography (PPG) is developed, which can be used to measure blood pressure and analyze rhythm, including the continuous detection of atrial fibrillation. The capabilities of the technology are shown in several form factors, including a miniaturized version resembling a common pulse oximeter to which the technology could be integrated in. Several main results are presented: i) the miniature finger probe meets the accuracy requirements of non‐invasive blood pressure instrument validation standard, ii) atrial fibrillation can be detected during the blood pressure measurement and in a continuous recording, iii) a unique comparison between optical and pressure sensing mechanisms is provided, which shows that the origin of both modalities can be explained using a pressure‐volume model and that recordings are close to identical between the sensors. The benefits and limitations of both modalities in hemodynamic monitoring are further discussed.

Mental workload is an important predisposing factor for mental illnesses such as depression and is closely related to individual mental health. However, the suboptimal accuracy of utilizing photoplethysmography (PPG) exclusively for mental workload classification has constrained its application within pertinent professional domains. To this end, this paper proposes a signal processing method that combines continuous wavelet transform (CWT) and cardiopulmonary coupling mapping (CPC) to classify mental load via a convolutional neural network (ResAttNet). The method reflects changes in mental workload, as assessed by changes in the association between heart rate variability and respiration. In this paper, the strengths and weaknesses of this method are compared with other traditional psychological workload monitoring methods, such as heart rate variability (HRV), and its validation is performed on the publicly available dataset MAUS. The experiments show that the method is significantly better than previous machine learning methods based on heart rate variability correlation. Meanwhile, the accuracy of the method proposed in this paper reaches 80.5%, which is 6.2% higher than in previous studies. It is comparable to the result of 82.4% for the ECG-based mental workload monitoring system. Therefore, the method of combining CWT and CPC has considerable potential and provides new ideas for mental workload classification.

Minimally invasive and non‐invasive hemodynamic monitoring technologies have recently gained more attention, driven by technological advances and the inherent risk of complications in invasive techniques. In this article, an experimental non‐invasive system is presented that effectively combines the capabilities of spectrometry, photoplethysmography (PPG), and arterial pressure measurement. Both time‐ and wavelength‐resolved optical signals from the fingertip are measured under external pressure, which gradually increased above the level of systolic blood pressure. The optical channels measured at 434–731 nm divided into three groups separated by a group of channels with wavelengths approximately between 590 and 630 nm. This group of channels, labeled transition band, is characterized by abrupt changes resulting from a decrease in the absorption coefficient of whole blood. External pressure levels of maximum pulsation showed that shorter wavelengths (<590 nm) probe superficial low‐pressure blood vessels, whereas longer wavelengths (>630 nm) probe high‐pressure arteries. The results on perfusion indices and DC component level changes showed clear differences between the optical channels, further highlighting the importance of wavelength selection in optical hemodynamic monitoring systems. Altogether, the results demonstrated that the integrated system presented has the potential to extract new hemodynamic information simultaneously from macrocirculation to microcirculation.

PARKINSON’S disease (PD) is a neurological disorder caused by degeneration of dopaminergic neurons in the midbrain. PD patients mainly suffer from motor symptoms, which significantly impact their daily lives. The diagnostic criteria for PD include the presence of muscle rigidity, tremor, and postural reflex disturbances. The Movement Disorder Society Unified Parkinson’s Disease Rating Scale (MDS-UPDRS) is the standard tool for evaluating PD symptoms, part III of which is dedicated to motor symptoms. That part involves a comprehensive set of specific physical examinations, and physicians assign semi quantitative scores from 0 to 4. However, this approach faces notable challenges, including the requirement for movement-disorder experts proficient in using MDS-UPDRS and the presence of substantial inter rater variability even among experts. Overcoming these challenges requires a quantitative and objective assessment method. Given that the rating of motor symptoms predominantly involves assessing kinematic characteristics, the integration of sensor-based devices and machine learning techniques holds the potential to outperform human experts in symptom evaluations. This study used the Leap Motion optical motion-capture device to quantitatively measure and analyze hand movements while 45 PD patients performed the following 3 tasks from the MDS-UPDRS part III: finger tapping (FT), hand opening and closing (OC), and forearm pronation and supination (PS). Data from these tasks were collected and processed, resulting in the extraction of 31 movement patterns for each task. Additionally, 69 statistical features were extracted from each movement pattern, yielding 2139 features for each task. We subsequently employed a random forest algorithm to select the top 15% of features based on the reduction of Gini impurity. These selected features were subsequently fed into a sequential-forward-floating-selection algorithm, combined with a support vector machine, to identify relevant feature combinations and predict the severity of the motor symptoms. The classification accuracy was 87.0% for FT, 93.2% for OC, and 92.2% for PS. One-way analysis of variance identified 13 features of the OC task that were significantly more discriminative for classifying the movement disability of PD patients ( p <0.05). This study highlights the effectiveness of combining sensor-based measurements with machine learning for symptom assessment, which demonstrated performance comparable to that of expert physicians. Implementing these findings in clinical settings holds the promise of applying objective and quantitative methods for evaluating the symptoms of PD and related disorders.

Radar-based human activity recognition (HAR) is a popular area of research. In this paper, we investigate methods to improve the generalization of micro-Doppler-based swimming activity recognition. We identify three main challenges to this task: a small dataset lacking motion diversity, inaccurate period estimation, and inefficient network design that does not take into account the unique characteristics of spectrograms. To address the limited motion diversity, we propose a spectral data augmentation tailored for micro-Doppler spectrograms, including positive augmentations that account for physical fidelity and negative augmentations that penalize the unrealistic examples. We also investigate self-supervised pre-training to effectively use these negative augmentations. To address inaccurate period estimation, we introduce a segmentation approach based on energy distribution to handle temporal period variation. To exploit the spreading pattern of limb motion in the Doppler dimension and the continuous properties of torso motion in the temporal dimension, we design a module consisting of both 2D convolution and 1D temporal dynamic convolution to serve as a feature extractor. Our evaluation on a self-collected swimming activity recognition dataset shows that our model achieves the best classification accuracy and robustness to corruptions, even compared to much larger models and multi-domain fusion models.

FCM algorithm is used to divide the ECG signal into QRS and non-QRS region. This paper presents a simple technique for automatic detection of cardiac beat (QRS-complex) in Electrocardiogram (ECG) using Fuzzy C-Means (FCM) clustering algorithm. The power line interference and baseline wander present in the ECG signal is removed using digital filtering techniques. Absolute derivative of the filtered ECG signal is calculated to enhance the QRS-complexes in the ECG signal. Algorithm performance is validated using original single lead ECG recordings from the CSE ECG database. Detection rate of 98.32% with 1.68% of false negative (FN) and 0.08% of false positive (FP) has been achieved.

The efficient detection of R-peaks in electrocardiogram (ECG) signal is extremely important for its further processing with regard to cardiac health monitoring. In this paper, an efficient R-peak detection algorithm based on wavelet packets has been proposed. The wavelet packets decompose ECG signal into different frequency subbands of uniform bandwidth. The features evaluated from a set of subbands are combined with heuristic detection strategy for beat detection. The proposed R-peak detection algorithm was tested on different data records of standard data bases Fantasia database, MIT-BIH arrhythmia database and self-recorded signals. A sensitivity íµí±† íµí±’ = 100% and a positive predictivity of +P = 100% for Fantasia database and íµí±† íµí±’ = 100%, +P = 100% for self-recorded signals and íµí±† íµí±’ = 99.94%, +P = 99.93% for MIT-BIH arrhythmia database were achieved using this proposed algorithm.

Spectral peak detection algorithms are often difficult to automate because they either rely on somewhat arbitrary rules, or are tuned to specific spectral peak properties. One popular approach detects peaks where signal intensities exceed some threshold. This threshold is typically set arbitrarily above the noise level or manually by the user. Intensity threshold-based methods can be sensitive to baseline variations and signal intensity. Another popular peak detection approach relies on matching the spectral intensities to a reference peak shape. This approach can be very sensitive to baseline changes and deviations from the reference peak shape. Such methods can be significantly challenged by modern analytical instrumentation where the baseline tends to drift, peaks of interest may have a low signal to noise (S/N) ratio, and no well-defined reference peak shape is available.We present a new approach for spectral peak detection that is designed to be generic and easily automated. Employing a histogram-based model for spectral intensity, peaks are detected by comparing the estimated variance of observations (the x-axis of the spectrum) to the expected variance when no peak is present inside some window of interest. We compare an implementation of this approach to two existing peak detection algorithms using a series of simulated spectra.

Using a simple nonlinear analysis method (E. M. Blanter et al., submitted manuscript, 2001), we are able to observe in the length of day the 18.6-year beating of the two main fortnightly lunar tides and to measure the amplitude of the smallest one with a great accuracy. We can thus estimate the associated zonal response coefficient kappa for this period. We find kappa = 0.311 +/- 0.010.

Electrocardiogram (ECG) is an important bioelectrical signal used to asses the cardiac state of a patient. It consists of a recurrent wave sequence of P-wave, QRS-complex and T-wave associated with each beat. The QRS-complex is the prominent feature of the ECG. This paper presents a simple method using K-means clustering algorithm for the detection of QRS-complexes in ECG signal. Digital filters are used to remove the power line interference and baseline wander present in the ECG signal. K-means algorithm is used to classify QRS and non-QRS-region in the ECG signal. The performance of the algorithm is validated using dataset-3 of the CSE multi-lead measurement library. Detection rate of 98.66% is obtained. The percentage of false positive and false negative is 1.14% and 1.34% respectively. The mean and standard deviation of the errors between automatic and manual annotations is calculated to validate the delineation performance of the algorithm. The onsets and offsets of the detected QRS-complexes are found well within the tolerance limits as specified by the CSE library.

Earth rotation observations and their implications are surveyed. The theory of the earth's rotation is summarized. The effects of tidal friction, postglacial rebound, and decade fluctuations on length of day and polar motion are considered. Present understanding of the earth's nutation is addressed.
